Advanced Topic 39 of 51 AI & Machine Learning

Embeddings

Dense vectors capturing meaning of items.

How it works

An embedding is a dense vector of numbers that represents an object, such as a word, sentence, image, user or product, in a space where similar items lie close together. Embeddings are learned by models, such as word2vec, transformers and contrastive networks, so that geometry reflects meaning or behavior. Similarity is measured with cosine similarity or dot product, and embeddings can be searched with nearest-neighbor indexes and visualized with dimensionality reduction.

Step-by-step walkthrough

  1. An embedding maps an item to a dense vector.
  2. Similar items are close together.
  3. king and queen are near.
  4. apple and banana are near each other but far from king.
  5. Distances and directions capture meaning, used in search and recommendation.

Where it is used

Semantic search, recommendations, clustering, duplicate detection, retrieval-augmented generation, classification with simple heads and cross-modal search use embeddings.

Common pitfall

Embeddings from different models are not compatible with one another, and changing the model requires re-embedding all data. They can encode societal biases and lose fine detail, and similarity does not always match relevance. Dimensionality and normalization choices affect search quality. Evaluate with real queries, store the model version and use approximate nearest neighbor search at scale.
