Attention Mechanism

Weighting which parts of input matter for each output.

How it works

Attention lets a model weigh which parts of the input are most relevant when producing each output. For a query, it computes similarity scores with a set of keys, normalizes them with softmax into weights and returns the weighted sum of corresponding values. Scaled dot-product attention divides scores by the square root of the key dimension, multi-head attention runs several attentions in parallel to capture different relations and self-attention uses the same sequence for queries, keys and values. It was introduced to improve sequence-to-sequence translation.

Step-by-step walkthrough

  1. For each output the model asks a query.
  2. It compares the query with every key.
  3. Scores become attention weights through softmax.
  4. The output is a weighted sum of the values.
  5. It focuses on the relevant parts of the input.

Where it is used

Transformers, language models, machine translation, image models, speech recognition and multimodal systems rely on attention, which also offers some interpretability through attention maps.

Common pitfall

Computing attention over a sequence of length n costs O(n squared) time and memory, limiting context length, which sparse, linear and flash attention methods address. Attention weights are not always faithful explanations. Positional information must be added because attention itself is order-agnostic. Use masking for padding and causal generation.
