Recurrent Neural Networks

Networks with loops handling sequences.

How it works

Recurrent neural networks process sequences by maintaining a hidden state that is updated at each time step from the current input and the previous state, so information from earlier steps can influence later outputs. The same weights are reused across time, and training uses backpropagation through time. They handle variable-length inputs such as text, speech, sensor streams and time series, and variants include bidirectional RNNs and sequence-to-sequence models with encoder and decoder.

Step-by-step walkthrough

  1. An RNN reads a sequence one element at a time.
  2. It keeps a hidden state as memory.
  3. The state updates with each new input.
  4. It can output at every step or at the end.
  5. Plain RNNs forget long-range information, since gradients vanish.

Where it is used

Speech recognition, language modeling, machine translation, handwriting recognition, music generation and forecasting used RNNs before transformers took over many tasks.

Common pitfall

Plain RNNs suffer from vanishing and exploding gradients, so they struggle with long-term dependencies, and sequential computation prevents parallelism, making training slow. Gated variants such as LSTM and GRU mitigate this. Clip gradients, use appropriate sequence lengths and padding with masks, and consider transformers or state-space models for long sequences.
