Backpropagation

Computing gradients layer by layer via the chain rule.

How it works

Backpropagation is the algorithm that efficiently computes the gradient of the loss with respect to every weight in a neural network by applying the chain rule backward from the output to the input. A forward pass computes and stores activations, then the backward pass propagates error signals layer by layer, reusing intermediate results, so the cost is about the same as a couple of forward passes. Optimizers then use the gradients to update parameters. Automatic differentiation frameworks implement it generally.

Step-by-step walkthrough

  1. The forward pass computes predictions layer by layer.
  2. The loss compares them with the truth.
  3. The backward pass applies the chain rule from output to input.
  4. Each weight gets a gradient.
  5. Gradient descent updates all weights, then repeat.

Where it is used

Training of every modern deep learning model in PyTorch, TensorFlow and JAX uses backpropagation, including transformers and diffusion models.

Common pitfall

Gradients can vanish or explode in deep or recurrent networks, hindering learning; solutions include careful initialization, normalization, residual connections and gradient clipping. Incorrect gradient implementations are a source of silent bugs, so gradient checking against finite differences helps. Memory use grows with stored activations, and checkpointing trades compute for memory.
