Hyperparameter Tuning

Searching settings that control training.

How it works

Hyperparameters are settings chosen before training, such as learning rate, tree depth, regularization strength, number of layers or the k in k-nearest neighbors, as opposed to parameters learned from data. Tuning searches for good values by evaluating candidates on validation data: grid search tries all combinations, random search samples them and is often more efficient, and Bayesian optimization, Hyperband and population-based training use past results to focus on promising regions. Early stopping saves compute.

Step-by-step walkthrough

  1. Hyperparameters are set before training, unlike learned weights.
  2. Examples: learning rate, tree depth, regularization strength.
  3. Grid search tries every combination.
  4. Random or Bayesian search is more efficient.
  5. Pick the best by validation score and test once at the end.

Where it is used

Every machine-learning project tunes hyperparameters, from boosting models to neural networks, using libraries such as Optuna, Ray Tune and scikit-learn.

Common pitfall

Tuning on the test set or too many times on a small validation set overfits to it, so use nested cross-validation or a separate test set. Ignoring randomness makes results unreliable. Poorly chosen search ranges, such as linear instead of logarithmic for learning rates, waste effort. Start with sensible defaults, tune the most influential parameters and track experiments.
