Reinforcement Learning Basics

Learning actions by maximizing reward from an environment.

How it works

In reinforcement learning, an agent interacts with an environment in discrete steps: it observes a state, takes an action, receives a reward and moves to a new state. The goal is to learn a policy that maximizes cumulative expected reward over time. The setting is formalized as a Markov decision process, with concepts such as value functions, discount factor and the exploration versus exploitation trade-off. Unlike supervised learning, there are no labeled correct actions, only delayed reward signals.

Step-by-step walkthrough

  1. The agent observes the state of the environment.
  2. It chooses an action.
  3. The environment changes and gives a reward.
  4. The reward is feedback, positive or negative.
  5. The agent learns a policy that maximizes long-term reward.

Where it is used

Game-playing systems like AlphaGo, robotics control, resource allocation, recommendation sequencing, chip design and tuning of language models with human feedback use reinforcement learning.

Common pitfall

Learning can require enormous numbers of interactions, rewards that are sparse or misdesigned cause agents to exploit loopholes, called reward hacking, and training is unstable. Simulations may not match reality. Define rewards carefully, start with simple environments, use baselines and run multiple seeds because results vary.
